Vector Garbage Collection

Vector garbage collection typically employs a two-phase deletion model. When a vector is deleted, it is first logically marked (e.g., with a vector tombstone) to prevent it from appearing in search results. The physical storage reclamation occurs later during a scheduled or triggered compaction process. This separation allows for fast delete operations and supports features like point-in-time recovery, as the data remains physically accessible until the garbage collection cycle runs.

Garbage collection is intrinsically linked to index maintenance. Most vector indexes (e.g., HNSW, IVF) are not update-in-place structures. Removing vectors creates 'holes' in the graph or partitions, degrading search performance and accuracy. A full or partial index rebuild is often required to maintain optimal recall and query latency. The frequency and strategy of these rebuilds—online vs. offline, incremental vs. full—are key operational trade-offs.

The process must respect the database's configured consistency level. In a distributed system, garbage collection must coordinate across replicas to ensure that a vector deleted on one node is also cleaned up on others, preventing phantom reads. Operations often use multi-version concurrency control (MVCC) to provide snapshot isolation, allowing ongoing queries to see a consistent pre-deletion state while garbage collection proceeds in the background.

Garbage collection is a resource-intensive operation. Key impacts include:

• CPU and I/O Spikes: Scanning and rewriting index files consumes significant compute and disk bandwidth.
• Increased Latency: Query performance may degrade during active compaction due to I/O contention.
• Memory Overhead: Tracking deletion metadata and managing compaction state requires additional RAM. Systems often implement load shedding or throttling to mitigate this impact during peak traffic periods.

The Write-Ahead Log (WAL) is central to garbage collection. All deletes are first durably recorded in the WAL. During garbage collection, the WAL is replayed or its segments are cleaned once the corresponding data has been compacted and persisted. This integration ensures durability (no data loss on crash) and enables point-in-time recovery (PITR), as the WAL provides a sequential record of all changes up to a specific timestamp.

Garbage collection can be triggered by various policies:

• Threshold-based: Activated when the ratio of deleted vectors to total vectors exceeds a set percentage (e.g., 20%).
• Schedule-based: Runs during a predefined maintenance window to minimize user impact.
• Manual/API-triggered: Initiated by an administrator or orchestration system.
• Background Continuous: A low-priority thread that constantly performs incremental cleanup. The chosen strategy balances storage efficiency against predictable performance.

A logical marker inserted into a vector database's index to indicate that a vector has been marked for deletion. The tombstone allows the system to immediately reflect the deletion to queries without performing the expensive physical I/O operation of rewriting the index. These tombstones are the primary input for the garbage collection process, which later reclaims the physical storage space in a batched, efficient operation.

A persistent, append-only log where all data modifications (inserts, updates, deletes) are recorded before they are applied to the main vector index. The WAL is fundamental to:

• Durability: Ensures no committed operation is lost in a crash.
• Recovery: Used to rebuild the index state after a restart.

A backup and restore capability that allows a vector database to be recovered to any specific moment in the past. It relies on a combination of full vector snapshots and the continuous Write-Ahead Log (WAL). PITR is a higher-level data safety mechanism that depends on clean log management, which is itself maintained by effective garbage collection processes to prevent log bloat and ensure efficient restore times.

A complete, read-only copy of a vector index and its associated metadata at a specific point in time. Snapshots are used for:

• Consistent Backups: A stable base for PITR.
• Testing & Cloning: Creating isolated copies of production data.
• Garbage Collection Context: A snapshot freezes the index state, allowing garbage collection to proceed on the live index while the snapshot remains immutable for readers, ensuring consistency.

A property of a data pipeline where inserting the same vector embedding multiple times results in the same final database state as inserting it once. This is crucial for:

• Garbage Collection Implications: Idempotency often relies on unique identifiers. When a vector is re-ingested, the system must correctly handle the lifecycle of the old identifier, potentially marking it for garbage collection if a replacement occurs.

A deployment strategy for clustered vector databases where nodes are restarted one at a time in a controlled sequence. This allows for:
